Building Production AI Pipelines with LangChain and LangGraph

A practical guide to building reliable, observable, and scalable AI pipelines using the LangChain ecosystem.

Beyond Prototypes

LangChain has evolved significantly from its early days. Combined with LangGraph for stateful workflows and LangSmith for observability, it now provides a robust foundation for production AI systems.

Architecture Patterns

Production AI pipelines typically follow one of these patterns:

  • Sequential Chain: Simple input → process → output flow
  • Router Chain: Classifies input and routes to specialized handlers
  • Agent Loop: LLM decides which tools to use and when to stop
  • State Machine (LangGraph): Explicit states, transitions, and checkpoints

Error Handling & Reliability

Key patterns for production reliability:

  • Implement retry logic with exponential backoff for API calls
  • Use fallback models (e.g., fall back to Haiku if Opus is overloaded)
  • Set timeouts and token limits to prevent runaway costs
  • Log all LLM inputs/outputs for debugging and improvement

Observability with LangSmith

You can't improve what you can't measure. LangSmith provides tracing for every LLM call, retrieval step, and tool invocation. Set up alerts for latency spikes, error rates, and cost anomalies.
